## Executive Summary

This document outlines a comprehensive caching strategy for the embellama library to achieve 2-5x throughput improvement. The plan addresses token caching, embedding caching, and KV cache optimization while respecting the `!Send`/`!Sync` constraints of the llama-cpp backend.

## Current State Analysis

### Architecture Constraints
- **Thread Model**: llama-cpp's `LlamaContext` is `!Send` and `!Sync`, requiring thread-local model instances
- **Processing Pipeline**: Text → Tokenization → Model Inference → Embeddings → Pooling/Normalization
- **Deployment**: Both library and server components with batch processing support
- **Current Performance**: No caching mechanisms in place, every request requires full processing

### Performance Bottlenecks
1. **Tokenization**: ~5-10% of processing time for each request
2. **Model Inference**: ~85-90% of processing time (primary bottleneck)
3. **Memory Allocation**: Repeated allocations for duplicate requests
4. **Batch Processing**: No optimization for similar inputs

## Proposed Caching Architecture

### Background: Understanding KV Cache in LLMs

Based on deeper analysis of llama.cpp's KV cache mechanism, we've identified additional optimization opportunities that weren't initially considered. The KV cache stores key and value vectors for each token in each Transformer layer during inference, enabling significant speedup by avoiding recomputation.

#### Key Insights from KV Cache Analysis

1. **Context Size vs KV Cache Size Clarification**:
   - `n_ctx` sets the **context window size** (max tokens)
   - KV cache memory = context_size × n_layers × d_model × 2 (for K and V)
   - Our current `kv_cache_size` config parameter is misleadingly named - it actually sets context size

2. **Current Implementation Limitation**:
   - We treat each embedding request independently
   - KV cache is cleared between requests
   - No reuse of computation for common prefixes

3. **Opportunity for Embedding Optimization**:
   - Many real-world inputs share common prefixes:
     - Code files with identical imports/headers
     - Documents with standard templates
     - API responses with common structures
   - These prefixes could be cached at the KV level

The expected 2-5x throughput improvement will make embellama more competitive and suitable for high-volume production workloads, while the comprehensive monitoring and management features ensure operational excellence.

The additional KV cache optimization opportunities identified in Phase 5 represent a potential next frontier for performance improvements, particularly for workloads with repeated patterns. These advanced optimizations could yield additional 30-50% improvements for specific use cases, though they require careful implementation and testing to ensure the complexity is justified by the performance gains.
